LimiX: Unleashing Structured-Data Modeling Capability for Generalist Intelligence https://arxiv.org/abs/2609.17488

What it solves

LimiX addresses the challenge of creating general-purpose foundation models for structured (tabular) data. Unlike traditional machine learning models that require task-specific training or parameter updates for every new dataset, LimiX provides a single pretrained model capable of performing classification, regression, and missing-value imputation across diverse datasets in a single forward pass.

How it works

LimiX-2 utilizes a Contextual Mechanism Network (CMN) paradigm and is pretrained using Context-Conditional Masked Modeling (CCMM). Instead of focusing solely on predicting a target based on a context, it learns a joint representation of the data generation process. The model is pretrained on massive synthetic datasets generated by structural causal models (SCMs) that cover various graph structures and functional mechanisms. This approach allows the model to possess "causal awareness," where its feature attention can be used to recover the causal skeleton of the data.

Who it’s for

It is designed for data scientists and ML engineers who need high-performance predictive modeling on tabular data without the overhead of training new models from scratch for every dataset, as well as researchers interested in causal discovery and tabular foundation models.

Highlights

  • Multi-task Capability: A single model handles classification, regression, and missing-value imputation without needing parameter updates.
  • State-of-the-Art Performance: Outperforms existing tabular foundation models and AutoGluon across benchmarks like TabArena, TALENT, and BCCO.
  • Causal Awareness: Able to encode direct causal relationships within its feature attention mechanism.
  • Scalable Architecture: Follows a log-linear scaling law, with available model sizes ranging from 2M to 400M parameters.
